La reconnaissance de formes est le processus d’identifier des formes informatiques à partir de données brutes. Les formes peuvent être de natures variées. L’une des utilisations les plus importantes de la reconnaissance des formes est l’interprétation des images médicales pour l’aide au diagnostic.
L’imagerie médicale constitue un thème d’actualité vue son importance dans la conception des systèmes d’aide au diagnostic/détection (CAD). En effet, différentes études confirment la capacité des CADs à détecter en stade précoce plusieurs maladies dangereuses, ce qui justifie la place et l’importance de l'interprétation des images médicales par le contenu, comme un axe de recherche en pleine évolution. A ce titre, plusieurs recherches sont menées afin d’étudier et de développer des outils d’aide au diagnostic (Computer-Assisted Diagnosis/Detection (CAD)). Ces derniers révèlent un schéma assez général : le prétraitement, la segmentation, l'extraction et la sélection de caractéristiques et enfin la classification pour générer une décision finale. Les phases de description et de classification constituent des étapes fondamentales qui conditionnent en grande partie les performances du système et la crédibilité des résultats.
L’objectif de notre travail, dans cette thèse est d’approfondir cet axe de recherche représenté par la sélection d'attributs pertinents pouvant représenter l'image médicale d'une manière efficace, cet axe particulièrement prometteur : d’une part, sur les aspects théoriques de sélection d'attributs afin d’améliorer la performance du système de classification ; d'autre part, en intégrant notamment les différentes techniques d'apprentissage pour la sélection d'attributs.
Nous avons également proposé une nouvelle approche se basant sur l'apprentissage actif et un des algorithmes méta-heuristiques d’optimisation par essaims particulaire (PSO) dans le but d'optimiser l'étiquetage des données non étiquetées se trouvant dans la majorité des bases médicales.
Nous apportons deux contributions qui ont été étayées dans ce travail. La première concerne un système d’aide au diagnostic (CADx) pour la classification de deux maladies dangereuses (le cancer du sein et le glaucome) conditionnent la survie de l’être humain : le cancer du sein et le glaucome. Différentes méthodes d’extraction de caractéristiques ont été utilisées afin de tirer le maximum d’informations présentes dans l’image médicale en entrée. Afin d’assurer une bonne représentation de l’image tout en maintenant en l’état les primitives pertinentes, une phase de sélection de caractéristiques a été effectuée. En effet, nous avons proposé deux schémas de sélection différents basés sur les Algorithmes Génétiques (AG) et le modèle wrapper tout en analysant le comportement des techniques d'apprentissage adoptées.
Le premier scénario de sélection de caractéristiques utilise une fonction objective wrapper représenté par un classifieur supervisé pour valider le sous-ensemble de primitives sélectionné. Cependant, dans le deuxième scénario, une fonction objective intègre un modèle wrapper semi supervisé ainsi que d'autres paramètres pour l’évaluation du sous-ensemble de caractéristiques.
Dans la phase de classification, nous avons fait appel à une technique d’apprentissage semi- supervisée représentée par le classifieur Séparateur Semi-Supervisé à Vaste Marge (S3VM) pour assurer une bonne discrimination entre classes.
Le système CADx a été validé sur deux bases de données médicales DDSM (Digital Database for Screening Mammography) ; une base de données dédiée au diagnostic de la maladie du cancer du sein) et RIM-ONE (An Open Retinal Image Database for Optic Nerve Evaluation), une base de de données pour le diagnostic de la maladie du glaucome. Nous avons exploité différentes mesures de performance entre autres : la précision, la sensibilité, la spécificité, la valeur prédictive positive et la valeur prédictive négative ainsi que le AUC généré à travers la courbe ROC, les résultats obtenus sont très encourageants.
Dans cette contribution, une précision = 0.921, une sensibilité = 0.948 et une spécificité = 0.912 ont été obtenues en utilisant la base de données DDSM. En validant l’approche sur RIM- ONE, nous avons atteint une précision = 0.952, une sensibilité = 0.972 et une spécificité = 0.929.
Nous avons constaté également que le deuxième scénario offre une nette amélioration des performances du système de classification. Après une étude empirique concernant la taille de la sous base de données non étiquetées à prendre en considération lors de l'apprentissage du classifieur S3VM, nous avons remarqué qu'avec 16% de données étiquetées (pour la base de données RIM-ONE) et 20% de données étiquetées (pour la base de données DDSM), le système génère un taux très acceptable de performance, avec précision = 0.948, spécificité = 0.963 et sensibilité = 0.942 (pour DDSM). En utilisant 169 images de la base de données RIM-ONE, une précision = 0.98, une sensibilité =0.99, une spécificité = 0.96 et un AUC = 0.98 ont été obtenues
La conclusion que nous pouvons tirer de la première contribution confirme que la prise en compte des images non étiquetées durant la phase de sélection et l’utilisation du classifieur S3VM ont permis d'augmenter les performances. Nous avons constaté que le choix de la meilleure portion de la base non étiquetée à utiliser lors de l'apprentissage semi supervisé (S3VM) ne peut pas être fixé d'une manière automatique. La valeur maintenue dans notre approche ne peut être généralisée pour d'autres bases médicales.
Pour remédier à cette limite, une deuxième contribution a été proposée dont l'objectif est de choisir le meilleur sous ensemble des images non étiquetées faisant avancer la classification, en adoptant une nouvelle représentation de l'apprentissage actif combiné avec une approche méta-heuristique.
Afin de pallier aux problèmes des techniques semi-supervisées cités précédemment, une technique d’apprentissage actif a été introduite dans la deuxième contribution. Dans ce travail, une hybridation entre une technique d’apprentissage actif et une technique de sélection de caractéristiques a été faite. La spécificité de cette proposition est l'introduction de la méthode d'optimisation par essaims particulaires (Particle Swarm Optimization (PSO)) pour améliorer la stratégie d'apprentissage actif. Dans cette contribution, une nouvelle façon de déterminer les instances incertaines a été proposée, l'algorithme PSO cherche parmi des quantités massives d'instances médicales non étiquetées celles considérées comme les plus informatives (incertaines). Ces instances doivent être étiquetées par un expert. Durant la validation de notre approche, une collection de dix-huit (18) base de données médicales a été utilisée. Les résultats obtenus ont montré de bonnes performances de classification ainsi qu’une réduction considérable de l’étiquetage manuel.
Nous avons observé que notre approche a permis d'obtenir une précision proche et parfois supérieure aux cas entièrement supervisés tout en interrogeant beaucoup moins d'étiquettes, ce qui signifie que notre approche AL-PSO conçue est efficace et cohérente en sélectionnant les échantillons informatifs. Ainsi, avec un effort d'étiquetage minime, une performance de classification élevée est atteinte. De plus, nous avons atteint des valeurs importantes en termes de spécificité (Weaning ~ 0,98, Prostate Cancer ~ 0,98, Cardiac Catheterization ~ 0,98, Parkinson ~ 0,97, Echocardiogram ~ 0,96).
Dans le but de bien analyser l’approche proposée, nous l’avons comparée avec d’autres mesures d’incertitudes connues dans l’apprentissage actif. L'approche AL-PSO réduit considérablement le coût d'étiquetage par rapport aux deux autres mesures d’incertitudes d'apprentissage actif. Par exemple, dans le cas de la base de données Diabetic Retinopathy Debrecen, les efforts d’expert pour la tâche d'étiquetage sont réduits de ~ 35% par rapport aux deux mesures : Marge entre les deux classes les plus probables et Entropie
Perspectives :
Les résultats obtenus par nos approches sont très satisfaisants, ils nous encouragent à poursuive cet axe de recherche. D'autres pistes restent cependant à envisager telles que :
- Concernant la première contribution, l’enrichissement de l’espace des caractéristiques serait très intéressant. L’utilisation d’autres caractéristiques de texture et de forme pour représenter la zone d’intérêt ainsi que l’incorporation des caractéristiques de couleurs afin d’extraire plus d’informations des images couleurs telles que les images du fond d’œil.
- Afin d'optimiser la sélection des primitives pertinentes par les AGs et dans le but de pallier les limites des algorithmes génétiques, essentiellement le choix aléatoire des paramètres initiaux, une analyse et proposition de nouvelles méthodes d'initialisation sont à prendre en considération.
- La détection des lésions (la tumeur pour les images mammaires ainsi que la détection du nerf optique dans les images du fond de la rétines) par de nouvelles techniques d'apprentissage automatique tel que l'apprentissage profond représente une nouvelle voie de recherche à creuser.
- Comme une extension de la deuxième contribution, il serait intéressant d'intégrer d'autres algorithmes d'optimisation évolutifs, de les comparer à notre approche. En outre, nous avons l'intention d'étudier l'effet de l'utilisation de critères de sélection dans le choix de l'ensemble initial de données étiquetées ℒ′ pour rendre les données aussi diverses que possible;
et, finalement, notre meilleure intention est de concevoir un système dédié à d'autres problèmes du monde réel tel que le problème de classification multi-classes pour les bases semi étiquetées combinant l'apprentissage actif et les algorithmes évolutionnaires.
